Convolutional neural networks (CNNs) offer parallel computation but may lose spatial information. The transformer architecture, integrating attention mechanisms, presents a potential solution, yet pure transformer models are computationally expensive and sensitive to dataset quality, affecting stability. SDAEs address these issues by offering robustness against outliers and noise and efficient parallel processing, as demonstrated in various applications like fault diagnosis.
Neural Network Architecture
To address shortcomings in existing RNN-based methods for predicting the RUL of lithium-ion batteries, researchers devised a comprehensive deep learning neural network architecture comprising three main components: health factor extraction, SDAE–transformer model, and RUL prediction.
Firstly, they tackled noise inherent in lithium-ion battery datasets in the health factor extraction stage using an SDAE. SDAE extends from the denoising Autoencoder (DAE) by introducing noise into input data and training the network to reconstruct the original data without noise, thus ensuring robust feature representation.
Multiple DAEs were employed to reconstruct inputs with noisy data, progressively assembling multiple denoising autoencoders to build a deep representation, enabling the extracting of multi-level abstract features from the data.
Secondly, the transformer model, introduced by Google in 2017, was utilized for RUL prediction. Departing from traditional RNN structures, the transformer model replaces them with a self-attention mechanism, improving performance significantly. Multi-head attention, a key feature, maps the same Query, Key, and Value to different subspaces for attention computation, thus reducing dimensionality and preventing overfitting. Additionally, positional encoding is employed to provide the model with information about the position of words in the input sequence. It facilitates capturing positional information crucial for accurate prediction.
In the third stage, the SDAE–transformer model prediction combines the denoising and prediction tasks within a unified framework. The researchers propose an objective function to optimize both tasks concurrently, aiming to predict the unknown battery capacity accurately.
The model incorporates a complete connectivity layer to map the representation of the final transformer unit for the final prediction. Experimental procedures involve collecting historical battery data, extracting health factors, normalizing them, integrating the SDAE module into the transformer architecture, and predicting the RUL while optimizing model parameters.

Model Performance Comparison
